Leadership treats early AI performance as representative of long term value. Small pilots are assumed to be scalable versions of the future state, rather than controlled experiments operating under unusually favorable conditions.
In reality, pilots often measure a very narrow slice of impact. They may involve a small user group, a limited data set, or a carefully curated workflow. These pilots rarely reflect the diversity of behaviors, edge cases, and operational friction present across the broader enterprise. Once AI is exposed to more users, more data sources, and more real world variation, effectiveness naturally declines.
At the same time, organizations underestimate cost exposure. Platform pricing often scales with usage, data volume, transactions, or support tiers. In house models require ongoing maintenance, tuning, and infrastructure investment that does not taper off after launch. Instead, tuning becomes permanent. Models require constant adjustment to remain relevant, accurate, and trusted.
Vendor dynamics further complicate the picture. Early in the relationship, platforms often appear flexible, responsive, and generous with support. Over time, as vendors face their own growth pressures or revenue targets, costs become more granular and restrictions increase. Support that was once easy to access becomes gated. Usage caps appear. Charges are applied by the minute, the request, or the team.
Organizations then face a difficult choice. Pay more to maintain support, or reduce reliance on the platform and handle issues internally. When budgets tighten, teams often choose the latter. AI initiatives continue forward through internal trial and error, without vendor guidance, increasing internal labor costs and slowing progress. The AI system technically remains live, but it is increasingly operated without full visibility or support.
Most ROI models fail to account for these dynamics. They freeze assumptions at launch and do not adjust as scope, usage, and cost structures evolve. The result is not a sudden failure, but a gradual realization that the business case no longer reflects what is actually happening.
The Move
Executives must model AI ROI dynamically, with declining marginal returns assumed by default. Early performance should be treated as directional, not definitive. ROI models must expand alongside scope, usage, and organizational complexity.
This starts with being realistic about pilot representativeness. Leaders should ask whether early results reflect the full diversity of teams, behaviors, and workflows the AI will eventually support. If not, early ROI should be discounted accordingly.
Cost modeling must also be more rigorous. Platform pricing, infrastructure growth, ongoing tuning, and support access should be stress tested under scaled conditions. Assumptions made during vendor selection should be revisited regularly, especially as contracts mature and usage expands. Due diligence should not end at purchase. It should continue throughout the lifecycle of the AI initiative.
Most importantly, executives should expect ROI to change over time. Marginal gains often decrease as easy wins are exhausted and complexity increases. This does not mean AI has failed. It means the organization must actively manage expectations, investment levels, and scope.
Dynamic ROI modeling forces better decisions. It allows leaders to intervene earlier, adjust deployment strategies, renegotiate vendor terms, or even pause expansion before value erosion becomes irreversible. It also creates a more honest internal conversation about where AI truly adds value and where it simply adds cost.
Treating early AI ROI as steady state performance is one of the fastest ways for costs to sneak up unnoticed. Treating ROI as a living model, grounded in operational reality, is how organizations avoid being surprised by systems that looked transformative at the start but quietly underdelivered over time.
